AI will no longer be evaluated based on the number of pilot projects launched or the sophistication of models in demo environments. Ultimately, it will be evaluated based on its ability to generate measurable financial impact, improve decision quality, reduce risks, and withstand critical scrutiny. The debate is shifting from “Can we build it?” to “Can we prove its effectiveness and justify how it works?”
According to a new report based on a Dataiku/Harris survey, 92% of CIOs worldwide say they have been asked at least once to justify AI results they could not fully explain.
The bottleneck of explainability
Many organizations assume that their ability to scale is limited by model performance, data quality, or integration complexity. However, the data reveals a more fundamental problem: explainability is becoming the determining factor.
When 85% of CIOs report that gaps in explainability have delayed or blocked production, this signals a structural problem. AI systems may function technically, but without traceability, oversight, and justification, they cannot move forward with confidence. The bottleneck then becomes their justification.
This problem is all the more significant as regulatory requirements accelerate. Seven out of ten CIOs believe that new audit or explainability requirements are very likely in the coming year. This timeline significantly reduces the leeway for reactive governance. Organizations that view explainability as a mere after-the-fact formality risk having to reconstruct their decisions under pressure, rather than benefiting from built-in transparency.
From the Black Box to the Business Intelligence System
During the early stages of AI adoption, limited visibility into model behavior was often tolerated. Pilot projects were conducted in controlled environments. The impact was contained. Risk exposure was manageable.
This tolerance disappears once AI systems influence critical business processes. As agents and predictive systems impact pricing decisions, fraud detection, product routing, customer interactions, and compliance processes, the lack of transparency becomes a liability for executives. 52% of CIOs believe that insufficient explanation could trigger a crisis capable of eroding customer trust or brand credibility.
In this context, explainability is about operational clarity. It encompasses at least five key points: What data informed the decision? What logical reasoning was followed? What safeguards were applied? Who approved or intervened? How has the situation evolved over time? If these answers cannot be provided quickly, scaling up poses a risk to the company.
The accountability gap is already evident
The pressure is mounting. Nearly three in ten CIOs report being frequently asked to justify AI results they cannot fully explain. This reveals a growing gap between the speed of deployment and the maturity of governance.
At the same time, agents are increasingly integrated into production systems. Yet only one-quarter of CIOs report being able to fully monitor all AI agents in production in real time. This indicates that influence is spreading faster than control.
When AI operates without full traceability, every successful deployment quietly increases its exposure. Executives may not be immediately held accountable. But as soon as a regulator, a board member, or an external stakeholder demands a justifiable explanation, the lack of structured explainability becomes glaringly obvious. And once it becomes obvious, it has significant consequences.
